Sorry, I forgot to mention this in my initial report:

I unplugged the USB headset, removed the kernel module snd_usb_audio, and
plugged the headset back in. The kernel module was reloaded (by udev I think)
and the headset was detected, but this didn't still solve the problem with
PulseAudio.

When PulseAudio is disabled, the headset can be accessed without problems
directly via ALSA, using aplay, speaker-test and also mplayer -ao alsa.

If one USB headset doesn't work, no USB headsets work (until a reboot),
independent of the manufacturer and the model. Headphones connected via
bluetooth do work nonetheless.

Pipewire is installed on the system, as it is a dependency of Firefox,
Chromium, Thunderbird, KRFB and xdg-desktop-portal.
